What techniques are used to classify text in NLP?

Rule-based NLP methods comprise of certain pre-defined linguistic rules. For example, if I want to classify a set of law articles into criminal law and commercial law related articles - then, I would first identify certain keywords associated with criminal law (such as, investigation, penalty, crime, imputation) and certain keywords associated with commercial law (statutes, contracts, transaction, etc.). The keywords, sentiment lexicons are counted pertaining to each category to finally categorize a paragraph or an article.

Rule-based methods are the librarians of text classification. They use specific rules (like keywords or sentence structures) to decide where a piece of text belongs. It's like saying, "If a book mentions 'wizard' or 'dragon,' it's probably fantasy." These methods are straightforward but need a lot of manual work to set up the rules.

Rule-based methods in NLP text classification rely on predefined rules and patterns. Some different ways below: --Keyword Matching: Identifying specific words or phrases that trigger classification into predefined categories. --Regular Expressions: Using regex patterns to find and categorize text based on syntactic rules. --Syntax-Based Rules: Classifying text by analyzing sentence structure and grammatical rules. --Ontology-Based Classification: Utilizing a structured framework of knowledge (ontologies) to categorize text based on context and semantics. --Decision Trees: Implementing tree-like models of decisions and their possible consequences to classify text.

In comparison to other text classification techniques in NLP, rule based techniques are more transparent and easier to explain as they work based on explicit decision making. It is often more reliable as conditions for classification are clearly defined. One example of a rule based technique is TextBlob library which provides a lexicon- based sentiment analysis approach implementable in Python.

To classify text using a rule-based method in NLP, you can follow a few steps. First, identify the key words or phrases that you want to use as indicators for classification. Then, create rules based on those indicators, such as if the text contains the word "positive" or "negative", it should be classified as such. You can also use regular expressions to identify patterns in the text that indicate a certain category. Finally, test your rules on a sample of text to see if they accurately classify the text according to your desired categories. Keep in mind that rule-based methods can be limited in their accuracy and flexibility compared to more advanced machine learning techniques.

There are multiple text classification machine learning models in NLP, including Naive Bayes, Logistic Regression, Support Vector Machines (SVM), Decision Trees as well as Boosting Algorithms. Deep learning algorithms have shown a great success in text classification, especially Word Embeddings (e.g., Word2Vec, GloVe), BERT, GPT (Generative Pre-trained Transformer), and hybrid Text-CNN (Convolutional Neural Network) and Text-RNN (Recurrent Neural Network) models. They look at loads of examples and learn to recognize which characteristics often appear in each category. Evaluating text classification models involves specific metrics. Accuracy measures the proportion of correctly classified instances. Precision and recall are crucial, especially in imbalanced datasets; precision measures the ratio of correctly predicted positive observations to the total predicted positives, while recall is the ratio of correctly predicted positive observations to all actual positives. The F1 score, combining precision and recall, provides a balance between them, especially useful when seeking a harmonious average of these metrics. Confusion matrices offer a detailed breakdown of predictions versus actual labels, highlighting true positives, false positives, true negatives, and false negatives.

In machine learning, evaluation metrics are used to measure the performance of a model on a particular task. The choice of evaluation metric depends on the specific problem being solved and the goals of the model. Some common evaluation metrics include accuracy, precision, recall, F1 score, and AUC-ROC. The above mentioned metrics are great measure of accuracy if the maping between the correct output and ground truth is one-to-one. But in many langauge processing problems the maping between input and output is not one-to-one. Take for example language transulation, An Arabic sentence can be translated to English in different ways wordings and sentences and all are correct. Thus other metrics are used to measure accuracy of NLP such as BLEU score , METEOR , SPICE , CIDE-r , and Rouge. Some of these meterics can evaluates the smantic similarity between words to produce a score instead of the literal matching. And all of these have trade offs. So there is no one fits all metric.

It's always important to evaluate any ML models before testing it. We can use many evaluation metrics interns of precision, recall and F1 score. Based on these metrics we can tune the NLP models. And test it.

As usual, the confusion matrix is the best way to evaluate the performance of classification. We use precision and recall to determine accuracy.

One of the challenges could be the higher number of variations that we may get for a single classification type. Now, this is why we have AI. However, I have seen this happening when users submit free-form text to represent the same thing. For example, they can provide a lengthy explanation or mention the same in a very short form even without completing the full word. We can still however capture all of these variations. I think there should also be some standardization methods in place as well. This could be a challenge as sometimes we don't even know the users who provide the values. In my opinion, Generative AI applied to text classification can be a great area to explore and find more opportunities for classification.

In my opinion, one of the main challenges in text classification is dealing with unbalanced data. If some classes are much more common than others, the model might learn to always predict the most common class, which can lead to poor performance. Techniques like oversampling, undersampling, and cost-sensitive learning can be used to address this issue. Another challenge is dealing with noisy or ambiguous labels. For example, if you're classifying tweets into positive and negative sentiments, there might be tweets that are sarcastic or ambiguous, which can be difficult to label correctly.

You can now leverage pre-trained LLMs (or even SLMs), without having to train your own model, for text classification. For example, you might pass an email to an LLM to be classified as spam or normal. The advantage of using LLMs is that they don't just count the number of times a words has appeared or only obvious patterns. They can understand the context and capture more subtle patterns.

Multi head attention is great for understanding of nuances and contexts in text. For specialized content model can be fine tuned. Model can easily adapt to new terminologies with as low as few 100 examples. Now anyone can do machine learning with better results.

Combining different models to improve classification accuracy is a technique I frequently employ. Ensemble methods like boosting and bagging can integrate the strengths of various models. In a complex text classification task, using an ensemble of SVMs, Naive Bayes, and a neural network provided a balance between accuracy and computational efficiency. BiLSTM, a variant of LSTM, processes data in both forward and backward directions. This bidirectional processing is particularly effective in understanding the context in text data. In a project involving natural language understanding, BiLSTM outperformed traditional LSTMs by effectively capturing the context from both directions, leading to more accurate text classification.
