Depends on the market and question - randomly throwing code at data will give you a lot of answers, few useful, even less actionable. I've seen analysts throw ML models at data with only 40 years massively over fitting. And still forget to cross validate. I've seen analysts transform data just to get it to find an answer they think is correct. Or bake in assumptions that skew results. I recommend a simple model, n+1 set up, and validate across dimensions (time, space and expertise). Iterate. Expand. Validate.

One thing I have often seen people overlook in building statistical models is not spending enough time understanding the data generation process. Consider generalized linear models. Every GLM stems from altering the data generation process. When I am building a statistical model, I ask this question: - What information do I get from the label about the data generation process that can help me select an appropriate statistical model? If the data generation process appears like: - Normal dist. → linear reg. - Poisson dist. → Poisson reg. - Bernoulli dist. → logistic reg. Understanding the data generation process gives so much clarity in the modeling stages. Consequently, we get to know which algorithm to use and, most importantly, why.

In my experience, some of the most important areas to improve model performance are: (1) business domain expertise (2) correct feature/target engineering In terms of business domain expertise, someone who knows the area can quickly direct you to features of the data that they believe will have the most predictive power. This is even more powerful than trying a fancier model. Target engineering isn't a phrase that you hear a lot in data science, but all datasets aren't inherently set up for ML. Sometimes you will have to transform the data to create the target variable, which is critical to do correctly. You don't want extraneous data making its way to the positive class of the target, causing worse model performance.

Domain expertise is key. Utilize domain knowledge to engineer features, select relevant variables, and interpret model results. This infusion of expertise can guide the model to capture underlying patterns more accurately, aligning the model's logic with real-world dynamics. From my experience, the most difficult part is actually determining whether the performance can be improved and if so, whether the incremental improvement is worth the associated costs.
