How can you clean text data effectively for sentiment analysis?

Text cleaning is not as crucial for LLMs as it is for traditional sentiment analysis methods. This is because LLMs are trained on massive amounts of text data and are able to learn complex patterns and relationships between words and phrases. As a result, they are often able to handle noisy or inconsistent data more effectively than traditional methods. However, text cleaning can still be beneficial for LLMs in some cases. For example, if the text data is particularly noisy or contains a lot of irrelevant information, text cleaning can help to reduce the dimensionality of the data and make it easier for the LLM to process. Additionally, if the text data is from a specific domain, such as social media or customer reviews

The preprocessing could vary usecase to usecase and the one conducting experiment has to determined that by themselves and it also depends on where did the text come from or source of text. However, there are certain things which we could refer as general noise and would make sense to remove it such as HTML tags, hyperlinks, usernames, and anything other than target language. There are many tools such as NLTK, spaCy, and re (regular expression) which are very useful to perform this task.

Noise in text refers to irrelevant or unwanted information that can hinder the quality and accuracy of analysis. Examples include punctuation, numbers, HTML tags, URLs, emojis, and spelling errors. To remove noise, you can employ tools like NLTK, spaCy, or regex libraries. For instance, Python's re module can be used to apply regular expressions for finding and replacing noise patterns in the text.

Sentiment analysis is used to analyze sentiments from product reviews, social media text, forums etc. Social Media carries noise in various formats like hashtags, urls, spelling errors. Sometimes Hashtags represent topics, so if you working on aspect based sentiment analysis, then you can't remove hastags. Emoji also carries sentiments. Social Media text is also not written in proper English, We can also translate social media text in a proper language using Generative AI or by training machine translation models. As word order doesn't differ much in the original text and translated text, so translation algorithm gives a good results. Other types of noise are also present like fake reviews, hate speech, trolls, ads in sentiment analysis.

If we are working on social media text, we must first analyze the distribution of words which are present in different cases. Sometimes, user write words in ALL_CAPS case to give more emphasis on those words. Those words carry user sentiments, we should not ignore them. Also, Named entities are present in upper case. If we are working on reviews, then we can normalize case in text. Social Media is generally short as compared to reviews, so by normalizing case we are reducing word variations and improving frequency distribution. But, sometime we lose words which are given more emphasis. So, before removing cases, we should search upper case words against named entities and sentiment words. Then, we should normalize case carefully.

Social media text is not written in proper English and it carries other type of words like emojis, hashtags, capital case words, urls etc. As we have discussed earlier, Emoji and capital case words carries sentiments. Topics can be present in the form of hashtags. So, we can also train sentence & word tokenizer on social media text. It would help us in identifying and segregating hashtags, emojis, capital case words, urls, username from the rest of social media text. It would improve sentiment analysis performance. If we use normal tokenizer on social media text, it will not work due to improper English. If we are working on product reviews, then we can use word tokenizer and sentence tokenizer from standard library like spacy or nltk.

Stopwords are frequently used, but relatively uninformative words like articles, prepositions, and pronouns. Removing stopwords from text can enhance focus on essential words that convey sentiment, reducing noise and redundancy. In NLTK, you can utilize the stopwords list to filter out these words from the text.

Sentiment Analysis can be performed on reviews in two different ways. 1)We can either use Bag of word approach for training classifier. As word order is not important, so we can remove stop words. 2)In another approach, we use linguistic features like word, POS category, presence of sentiment words. We can create training data in CONLL format, and use sequence labeling algorithms like CRF, HMM, RNN, LSTM for training. Here word order is important. Stop words connects sentiment words with product features. We cannot perform certain task without stopword. For example, We cannot perform POS tagging if we remove stop words. Presence of Preposition "in/on/at" is important for Named entity recognition.

Stemming and lemmatization are methods to reduce words to their base or root forms. Stemming trims word suffixes, while lemmatization takes into account grammatical and semantic context. Text is typically cleaned before it’s vectorized. Examples of cleaning include converting characters to lowercase (so, for example, “Excellent” is equivalent to “excellent”), removing punctuation symbols, and optionally removing stop words—common words such as the and and that are likely to have little impact on the outcome. Once cleaned, sentences are divided into individual words (tokenized) .Scikit-Learn has three classes that handle the bulk of the work of cleaning and vectorizing text:CountVectorizer,HashingVectorizer,TfidfVectorizer.All three classes are capable of converting text to lowercase, removing punctuation symbols, removing stop words, splitting sentences into individual words, and more.

Sentiment Analysis is an NLP technique to understand the emotion of a given phrase or text. Word vectors efficiently transform text into meaningful numbers. During the initial stages of development in NLP, word vectors were generally representations of individual words with no or less contextual capture done using BOW, TF-IDF, etc, then came RNNs, and LSTMs to learn to capture the context of words semantically. With the creation of Transformers texts with longer lengths are also efficiently vectorized into embeddings, unlike LSTMS or RNNs where the same was not optimized.

I think in real world settings, collecting implicit (or explicit) signals/metadata about the utility of the text is quite a useful method to clean up text data.

With Large Language models like (Bert in '19 and now GPTs in '22 onwards) coming into the scene, many of the text cleaning methods are not needed since vectorisation of words/subwords have become far more multi-dimensional, than they were using traditional count vectorisor or tf-idf methods. A simple few shots prompt can do the job of a very context specific sentiment classifier using an LLM with minimal text cleaning.

All the key points have been already mentioned: tokenization, denoising (e.g., removing punctuation), stemming, lemmatization, stop-words removal, and case normalization. I will simply add that exceptions do apply depending on the goal. For instance, in sentiment analysis, outright deletion of punctuation may cause loss of information: we can all agree that a smiley “:)” should not be dropped in this case.

It is difficult to make a case for conventional sentiment analysis given that LLMs are able to perform this task accurately and with more detail than conventional sentiment analysis models - and there is very little data cleaning required. Just tokenize your inputs using a compatible tokenizer, and the model will handle vectorization behind the scenes. Even the smaller versions of modern LLMs (i.e. llama-2 or mistral 7b) are more than powerful enough to handle sentiment analysis, and certain models like gpt-3.5-turbo are finetuned to return a response as structured data (i.e. a JSON array) so that you can use their output programmatically without further processing.
