If the data that need to be analyzed does not have clearly defined objectives, best would be start with a couple of checks. Are there any missing values, what is the the distribution of my data. If the data is unstructured or text data, what is the vocab size. Next I would visualize the data, before deciding if there is any cleaning that is required.

In my experience I think the best approach even before looking at the data set it understanding the company. What is the data they are sending over. How is it collected? What is it used for at the moment? Then once you are familiar with the company. You can look through the data to find stats to help the company. In most of the cases, you'd be faced with an ugly data set that will require some considerable time to clean it. Don't be panic - it's a great opportunity, as that's the magic of unveiling hidden patterns. There are plenty of tools that you can use, the well-known R/Python for the coding guys, or you can do that even in a BI tool like Tableau/PowerBI without using code.

By having produced the summary statistics in the exploration step above, it would be easy to perform data cleaning and transformations as needed. For example, if some variables have positive skewness due to outliers, it may be good to perform log transformation. Also, other variables may need recoding or grouping.

When cleaning data, I prefer to get as SPECIFIC in how I break down different fields as possible. This is best done in the entry stage, but more often, you are inheriting a data set (either in a CRM or in a CSV) that needs cleaning. If you are as specific as possible—either in entry or cleanups—you have greater depth of ability in the analysis stage.

Sure there are many techniques that can be applied, yet the challenge is not only to find the appropriate technics - which are in part directed by the data- but to determine a research question that would provide valuable insights to the stakeholders. A first step would be to decide if this is a data mining project or a diagnostic analysis project. For data mining, broad patterns within the data may be discoverd that would then be basis for deeper analysis. Diagnostic analysis may answer questions such as "are female or male customers more likely to promote our products?", " did product A perform significantly better than product B in a given time period??" etc.

First, familiarise yourself with the domain/business where the data came from; think about what might be some interesting relationships or visualisation to look at. For example you might work at Spotify and are exploring a music dataset. You can probably start with things like top/bottom performing songs, distribution of songs between countries, genre/artist popularity over time, histograms of listening patterns by time of day or day of the week. Then you can start going into more detail: what attributes make a song successful (genre, artist popularity, tempo, mood etc) and which of these are more important than others. Finally, you can use the attributes you've identified to build a ML model to predict how successful a song might be.

One of the most prominent step is about communicating data with others in such a way that first few seconds should be good enough to get the attention and know what is happening. Mostly, I follow 80-20 rule, 80% of normal visualisations and 20% of complex/animations which becomes eye catchy as well but don't forget visualisation should be easy to understand not difficult when following visualisations. Almost all of the tools in market do similar things and the difference is I am a big fan of Rshiny and RMarkdown as well and quarto is almost similar to Rmarkdown. Quarto provides a unified authoring framework for data science, combining your code, its results, and your prose.

It's a good practice to organize the key points by their level of difficulty and potential impact. Usually, focusing on value is the most straightforward strategy in these cases, for example plotting some figures against your value metric (for example earnings) and trying to infer some relationships.

Start with EDA to reveal patterns and distributions. Develop hypotheses during this phase and create target variables based on these assumptions. Validate hypotheses by experimenting with simple predictive models, using visualizations to depict correlations or trends. Refine analyses iteratively, adjusting hypotheses and strategies based on discoveries. Post-analysis, effective communication of findings with stakeholders is crucial, providing insights into both the limitations and opportunities within the data, and addressing any overly optimistic expectations that stakeholders may harbor.

Wear the stakeholder’s hat. When an analysis has no clear goals, you can put yourself in the stakeholders position and ask questions of the data that they ask you down the road. This can help guide the direction that you begin exploring the data.

You need to get the other departments you work with on board with clean data, especially if your organization relies on a CRM. Just last week, I wasted hours because a coworker entered all the cities for our clients as “City, State” while leaving the state field empty rather than entering city and state separately. A lot of people misunderstand a CRM as a data dump or a Rolodex and that creates enormous clean up for data analysts that could have been easily avoided.

As the analysis progresses, refine and evolve the project objectives based on the emerging insights. This adaptive approach ensures that the analysis remains closely aligned with the evolving needs of the business/research.
